An adaptive signal classification procedure. Application to aircraft engine condition monitoring

Die Leistungsfahigkeit einer Gasturbine nimmt uber die Betriebszeit ab. Ursache hierfur sind einerseits Einzelereignisse wie z. B. Fremdkorpereintritte und andererseits Alterungsmechanismen wie z. B. Verschleis. Ziel der Zustandsuberwachung der Gasturbine ist es, die Leistungsfahigkeit der Gasturbine zu jeder Zeit so exakt wie moglich zu bestimmen, um eine Prognose uber die zu erwartende Restbetriebszeit zu gewinnen. Die Zustandsuberwachung gliedert sich in die Teilbereiche Detektion (Erkennen von Schaden), Identifikation (Zuordnung von Schaden zu den jeweiligen Komponenten), Diagnose (Berechnung der quantitativen Verschlechterung der Leistungsparameter) und Prognose. Sie ist von der Anzahl der Messgrosen und deren Position abhangig. Fur den Fall, dass Messgrosen wahrend der Betriebszeit ausfallen, sinkt die Gute der Detektion, Identifikation, Diagnose und zwangslaufig der Prognose. Um zumindest eine Abschatzung des vom Schaden betroffenen Komponentenbereiches der Gasturbine zu erhalten, bedarf es Identifikationsalgorithmen, die sowohl robust gegenuber Messrauschen als auch gegenuber Messgrosenausfallen sind. Voraussetzung ist die Detektion eines Schadens in der Gasturbine. Daraus ergibt sich die Forderung nach einem Identifikationsbackup-System, welches parallel zur Kausalkette der Zustandsuberwachung arbeitet. Der sich daraus ergebende Vorteil ist, dass trotz einer ungunstigen Instrumentierung der Gasturbine fur die Zustandsuberwachung ein Anhaltspunkt fur die Schadensuche an die Wartungsingenieure gegeben wird.
In dieser Arbeit wird ein Konzept fur eine robuste Identifikation entwickelt. Das Konzept umfasst mehrere Algorithmen um die maximale Anzahl an zu Verfugung stehenden Informationen zu verwenden. Diese Informationen sind Messgrosen unterschiedlicher Herkunft. Der entscheidende Vorteil dieses Konzeptes ist, dass es robust gegenuber Messgrosenausfallen ist und sowohl modellbasierte als auch nicht modellbasierte Erwartungswerte zur Identifikation in Betracht gezogen werden.
Fur die robuste Identifikation anhand modellbasierter Erwartungswerte wird ein Fusionsverfahren vorgestellt. Dieses Verfahren verbindet ein modellbasiertes und nicht modellbasiertes Verfahren. Das erste Verfahren ist ein Verfahren, welches kombinatorisch ein lineares Gasturbinenmodell auswertet. Aus den Losungen der einzelnen Kombinationen erfolgt die Schatzung der betroffenen Komponenten der Gasturbine. Die anderen verwendeten Verfahren basieren auf der Mustererkennung anhand simulierten Signaturen von Schaden. Die erhaltene Losung aus den Verfahren wird auf ihre physikalische Glaubwurdigkeit mittels einer Systemsensitivitat uberpruft. Die endgultige Identifikation erfolgt durch eine Rangliste an moglichen Schaden gewichtet mit einer Zugehorigkeitswahrscheinlichkeit.
Fur vorhandene aber nicht modellierbare Erwartungswerte, beispielsweise wie Vibrationsgrosen, Abgaskonzentrationsgrosen oder Oldaten, wird eine Expertendatenbank herangezogen, welche durch ein statistisches Verfahren zur Mustererkennung ausgewertet wird. Die Zugehorigkeitswahrscheinlichkeit der gemessenen Messgrosensignatur zu einem Schaden aus der Expertendatenbank wird mittels der Schatzung der Wahrscheinlichkeitsdichte errechnet. Die Expertendatenbank ist nach dem Konzept des fallbasierten Schliesens (Case Based Reasoning) implementiert und wachst kontrolliert. Als vorteilhaft hat sich erwiesen, dass trotz weniger Eintrage im Anfangsstadium der Datenbank eine Identifikation durch die gewichtete Fusionierung zum modellbasierten Identifikationsverfahren moglich ist.
In Anbetracht der schlechten Eignung heutiger Serieninstrumentierungen fur die Zustandsuberwachung wird abschliesend ein Vergleich zwischen drei unterschiedlichen Ansatzen fur die Auswahl von Messgrosen fur eine Serieninstrumentierung vorgestellt und basierend auf der Beobachtbarkeitsanalyse diskutiert. Fur die neuartige Messgrosenauswahl der optimalen Beobachtbarkeit wird ein Sortieralgorithmus vorgestellt, welcher uber eine Vielzahl an Betriebspunkten eine Kompromisslosung zwischen den bekannten Beobachtbarkeitskriterien findet. Es wird gezeigt, dass ein betriebspunktabhangiges Messgrosenauswahlverfahren, bedingt durch die besseren Beobachtbarkeitseigenschaften uber die Betriebspunkte hinweg, robuster gegenuber leichten Storungen im Messvektor ist. 
Die Umsetzung der Konzepte erfolgt durch die Erweiterung eines bestehenden Zustandsuberwachungssystems (HealthGT®). Es wird gezeigt, wie das Backup-System fur die Identifikation bei diversen Messgrosenausfallen eine Abschatzung der betroffenen Komponenten ermoglicht. Zusatzlich wird ein durch das Verfahren der optimalen Beobachtbarkeit erhaltenes Set an Messgrosen fur die Zustandsuberwachung von Gasturbinen diskutiert und wichtige Messgrosen fur die Zustandsuberwachung von Gasturbinen identifiziert. 
It is a well known fact that as time passes, the performance of a gas turbine decreases. This can be caused by specific events such as foreign object damages or aging mechanisms such as tribological phenomena. The monitoring of the operating conditions of a gas turbine has as a target the possible most exact determination of its performance at any time. The purpose is to gain a prognosis concerning the expectable operating time left. The monitoring of the operating conditions is structured as follows: detection (recognition of faults), identification (assignment of faults to the respective components), diagnosis (calculation of the performance parameters) and prognosis. This specific monitoring significantly depends on the available number of measurements and the position they hold. If some measurements become inoperable or malfunction during operating time, the performances of detection, identification, diagnosis and inevitably that of prognosis decrease. In order to obtain at least an estimation of the faults of the respective area, the requirement of identification algorithms arises. They should be resistant concerning measurement noise as well as measurement bias. These facts claim for an identification back up system that runs parallel to the causally determined performance monitoring. In spite of bad instrumentation, it provides maintenance engineers with indications and references during their search for faults.
This thesis deals with the development of a concept that enables a robust identification of faults of gas turbines. It is characterised by the fusion of several algorithms. It also makes use of the maximum amount of available information of measurement data. The decisive advantage of this concept is its robustness towards measurement malfunctions and faults. In achieving fault identification it also takes in consideration measurements that cannot be simulated for expectancy values. 
The present work presents a fused procedure concerning the robust identification of faults based on measurements that can be simulated. On one hand it consists of a known procedure that combinatorially evaluates a linearised gas turbine model. As a result of combinatorics it can render an estimation of the affected areas. On the other hand it is based on procedures of pattern recognition of already traced and simulated faults. The innovative aspect of this combined procedure consists in the interpretation of both fault indicators obtained. Their physical reasonableness is verified and checked by a sensitivity analysis of the system. The final identification of the type of faults is visualised by means of a ranking table of possible fault types laying weight on the probability of their affiliation.
For measurements that cannot be simulated, such as vibration values, exhaust values etc, the generation of an expert data bank is recommended. Using a statistic procedure, the data bank leads to evaluations within pattern recognition. The probability of affiliation of the obtained measurement signature concerning the fault type that was recorded with the data bank is calculated by means of estimation of the probability density. The expert data bank is implemented using the concept of Case Based Reasoning and it is steadily growing under control. The innovative feature of the procedure presented in this paper, as opposed to the ones published so far, is that in spite of the small number of data at the initial stage of the data bank, fault identification is enabled. This happens due to the weighted fusion with the previous described identification algorithm.
In conclusion a comparison between three different approaches concerning the choice of measurements in service instrumentation of a gas turbine is presented. The mathematical principles of the observability analysis are repeated and the procedure of selection based on observability analysis is discussed. A sorting algorithm for the innovative selection of optimal observability measurements is also presented. Using a multitude of operating points, it enables the finding of a compromise solution between known observability criteria. It is demonstrated that a measurement selection procedure, depending on engine operating points, if conditioned by better properties of observability is more robust towards light faults within vector measurement.
The implementation of the concepts takes place within an existing monitoring system (HealthGT®).The way the back up system of fault identification calculates an estimative fault type is pointed out. This is to be applied when diverse measurement failures occur. Additionally the selections of measurement values are debated and essential measurement sizes for monitoring of operating conditions of gas turbines are identified.

On the two days of 4 and 5 April sessions were conducted on economics, statistics, and function of ECM; implementation of ECM; instrumentation; and computers, fault logic, and displays.
