Privacy preserving association rule mining in vertically partitioned data

The Health Insurance Portability and Accountability Act, also known as HIPAA, was first delivered to congress in 1996 and consisted of just two Titles. It was designed to protect health insurance coverage for workers and their families while between jobs. It establishes standards for electronic health care transactions and addresses the issues of privacy and security when dealing with Protected Health Information (PHI). HIPAA is applicable only in the United States of America.

This paper introduces a framework for distributed learning (regression) on attribute-distributed data. First, the convergence properties of attribute-distributed regression with an additive model and a fusion center are discussed, and the convergence rate and uniqueness of the limit are shown for some special cases. Then, taking residual refitting (or boosting) as a prototype algorithm, three different schemes, Simple Iterative Projection, a greedy algorithm, and a parallel algorithm (with its derivatives), are proposed and compared. Among these algorithms, the first two are sequential and have low communication overhead, but are susceptible to overtraining. The parallel algorithm has the best performance, but has significant communication requirements. Instead of directly refitting the ensemble residual sequentially, the parallel algorithm redistributes the residual to each agent in proportion to the coefficients of the optimal linear combination of the current individual estimators. Designing residual redistribution schemes also improves the ability to eliminate irrelevant attributes. The performance of the algorithms is compared via extensive simulations. Communication issues are also considered: the amount of data to be exchanged among the three algorithms is compared, and the three methods are generalized to scenarios without a fusion center.

Attribute-Distributed Learning: Models, Limits, and Algorithms

Most of the cryptographic work in privacy-preserving distributed data mining deals with semi-honest adversaries, which are assumed to follow the prescribed protocol but try to infer private information using the messages they receive during the protocol. Although the semi-honest model is reasonable in some cases, it is unrealistic to assume that adversaries will always follow the protocols exactly. In particular, malicious adversaries could deviate arbitrarily from their prescribed protocols. Secure protocols that are developed against malicious adversaries require utilisation of complex techniques. Clearly, protocols that can withstand malicious adversaries provide more security. However, there is an obvious trade-off: protocols that are secure against malicious adversaries are generally more expensive than those secure against semi-honest adversaries only. In this paper, our goal is to make an analysis of trade-offs between performance and security in privacy-preserving distributed data mining algorithms in the two models. In order to make a realistic comparison, we enhance commonly used subprotocols that are secure in the semi-honest model with zero knowledge proofs to be secure in the malicious model. We compare the performance of these protocols in both models.

Privacy-preserving data mining in the malicious model

Traditionally, many data mining techniques have been designed in the centralized model in which all data is collected and available in one central site. However, as more and more activities are carried out using computers and computer networks, the amount of potentially sensitive data stored by business, governments, and other parties increases. Different parties often wish to benefit from cooperative use of their data, but privacy regulations and other privacy concerns may prevent the parties from sharing their data. Privacy-preserving data mining provides a solution by creating distributed data mining algorithms in which the underlying data need not be revealed. In this paper, we present privacy-preserving protocols for a particular data mining task: learning a Bayesian network from a database vertically partitioned among two parties. In this setting, two parties owning confidential databases wish to learn the Bayesian network on the combination of their databases without revealing anything else about their data to each other. We present an efficient and privacy-preserving protocol to construct a Bayesian network on the parties' joint data
