Pattern Recognition with Fuzzy Objective Function Algorithms

Clustering is the unsupervised classification of patterns (observations, data items, or feature vectors) into groups (clusters). The clustering problem has been addressed in many contexts and by researchers in many disciplines; this reflects its broad appeal and usefulness as one of the steps in exploratory data analysis. However, clustering is a difficult problem combinatorially, and differences in assumptions and contexts in different communities has made the transfer of useful generic concepts and methodologies slow to occur. This paper presents an overview of pattern clustering methods from a statistical pattern recognition perspective, with a goal of providing useful advice and references to fundamental concepts accessible to the broad community of clustering practitioners. We present a taxonomy of clustering techniques, and identify cross-cutting themes and recent advances. We also describe some important applications of clustering algorithms such as image segmentation, object recognition, and information retrieval.

Data Mining - Concepts and Techniques.

We compare learning vector quantization, fuzzy learning vector quantization, and a deterministic scheme called the dog-rabbit (DR) model for generation of multiple prototypes from labeled data for classifier design. We also compare these three models to three other methods: a dumping method due to Chang (1974); our modification of Chang's method; and a derivative of the batch fuzzy c-means algorithm due to Yen-Chang (1994). All six methods are superior to the labeled subsample means, which yield 11 errors with 3 prototypes. Our modified Chang's method is, for the Iris data used in this study, the best of the six schemes in one sense; it finds 11 prototypes that yield a resubstitution error rate of 0. In a different sense, the DR method is best, yielding a classifier that commits only 3 errors with 5 prototypes.

Kohonen-like clustering algorithms (e.g., learning vector quantization) suffer from several major problems. For this class of algorithms, output often depends on the initialization. If the initial values of the cluster centers are outside the convex hull of the input data, such an algorithm, even if it terminates, may not produce meaningful results in terms of prototypes for clustering. This is because it updates only the winner prototype with every input vector. In this paper we propose a generalization of learning vector quantization (which we shall call a Kohonen clustering network or KCN) which, unlike other methods, updates all the nodes with each input vector. Moreover, the network attempts to find a minimum of a well defined objective function. The learning rules depend on the degree of match to the winner node; the lesser the degree of match with the winner, the more is the impact on nonwinner nodes. Our numerical results show that the generated prototypes do not depend on the initialization, learning coefficient, or the number of iterations (provided KCN runs for at least 200 passes through the data). We use Anderson's IRIS data to illustrate our method; and we compare our results with the standard Kohonen approach.© (1992) COPYRIGHT SPIE--The International Society for Optical Engineering. Improving convergence and performance of Kohonen's self-organizing scheme

Spectral co-clustering is a generic method of computing co-clusters of relational data, such as sets of documents and their terms. Latent semantic analysis is a method of document and term smoothing that can assist in the information retrieval process. In this article we examine the process behind spectral clustering for documents and terms, and compare it to Latent Semantic Analysis. We show that both spectral co-clustering and LSA follow the same process, using different normalisation schemes and metrics. By combining the properties of the two co-clustering methods, we obtain an improved co-clustering method for document-term relational data that provides an increase in the cluster quality of 33.0%.

Adapting Spectral Co-clustering to Documents and Terms Using Latent Semantic Analysis

Image processing covers a lot of territory, including its use as an enabling technology for the more ambitious undertaking which is nowadays called computer vision (Jain et al., 1995). A comprehensive survey of fuzzy models for image processing and computer vision would require its own volume (cf. Chapter 5 of Bezdek et al., 1999). This chapter is confined to applications of image processing in medical domains that are not based on neural network models or mathematical morphology. Others chapters of this handbook address these topics. Even these strict constraints leave us in the unenviable position of having to choose from more excellent work than we have space to review, and the perhaps inexcusable position of being ignorant about some work of which we are simply unaware. With apologies to the many authors of papers in either category, we offer a snapshot of the use of fuzzy models for image processing in computational medicine.

Conventional cluster validity techniques usually represent all the validity information available about a particular clustering by a single number. The display method introduced here is an alternative to standard validity functionals. The proposed approach uses intensity images generated from the results of any prototype generator clustering algorithm as a means for cluster validation. Several numerical examples are given to illustrate the method.
